We address the problem of identifying underground anomalies (e.g. holes) based on gravity measurements. This is a theoretically well-studied yet difficult problem. In all except a few special cases, the inverse problem has multiple solutions, and additional constraints are needed to regularize it. Our approach makes general assumptions about the shape of the anomaly that can also be seen as sparsity assumptions. We can then adapt recently devel- oped sparse reconstruction algorithms to address this problem. The results are extremely promising, even though the theoretical assumptions underlying sparse recovery do not hold for gravity problems of this kind. We examine several types of sparse bases in the context of this gravity inverse problem and compare and contrast their relative merits.

Any part of the world can be viewed and modelled in terms of its chosen qualitative and/or quantitative properties, OR its structure. The former approach has been used by nearly the whole of ‘human intellectual endeavor’, i.e conventional science of physics, the arts etc. Development of the latter or the ‘systemic view’ is the subject matter of the current work. The Purpose of Change is Problem Solving suggests that the ‘structural view’ is empirical, pervasive throughout experience and as such results in a single domain as opposed to conventional science which consists of many domains like mechanics, electricity etc. Thus, a unique approach is required which is based on ‘general principles of systems’ translated into operational form by the symbolism of processed natural language called ‘linguistic modelling of scenarios’ which can carry mathematics and uncertainties. To model scenarios with complex structure, a description or story in natural language is expressed in terms of homogenous language of one – and two – place sentences, the ‘elementary constituents’ of which complex structures can be constructed [like a variety of buildings from bricks]. To correspond to the single domain, based on the logic of causation, a single scheme of ‘Management/producers – Product – User/consumer’ is proposed which is immediately applicable to structuring scenarios and guides their detailed linguistic modelling or design. The approach, subject to debate, can have significant impact on society and education, especially that of engineering which lacks a ‘comprehensive theory of structure’ of problematic scenarios.

Anomaly detection problems can be classified into three categories: point anomaly detection, collective anomaly detection and contextual anomaly detection. Many algorithms have been devised to address anomaly detection of a specific type from various application domains. Nevertheless, the exact type of anomalies to be detected in practice is generally unknown under unsupervised setting, and most of the methods exist in literature usually favor one kind of anomalies over the others. Applying an algorithm with an incorrect assumption is unlikely to produce reasonable results. This thesis thereby investigates the possibility of applying a uniform approach that can automatically discover different kinds of anomalies. Specifically, we are primarily interested in Spectral Ranking for Anomalies (SRA) for its potential in detecting point anomalies and collective anomalies simultaneously. We show that the spectral optimization in SRA can be viewed as a relaxation of an unsupervised SVM problem under some assumptions. SRA thereby results in a bi-class classification strength measure that can be used to rank the point anomalies, along with a normal vs. abnormal classification for identifying collective anomalies. However, in dealing with contextual anomaly problems with different contexts defined by different feature subsets, SRA and other popular methods are still not sufficient on their own. Accordingly, we propose an unsupervised backward elimination feature selection algorithm BAHSIC-AD, utilizing Hilbert-Schmidt Independence Critirion (HSIC) in identifying the data instances present as anomalies in the subset of features that have strong dependence with each other. Finally, we demonstrate the effectiveness of SRA combined with BAHSIC-AD by comparing their performance with other popular anomaly detection methods on a few benchmarks, including both synthetic datasets and real world datasets. Our computational results jusitify that, in practice, SRA combined with BAHSIC-AD can be a generally applicable method for detecting different kinds of anomalies.
